Why AI breaks out of context – and how to fix it

The gap between what AI promises and what it delivers is not subtle. The same model can produce accurate, useful results in one system and general, irrelevant results in another.
The problem is not the model. It is the total.
Most business systems are not designed for how AI works. Data is distributed across devices. Ownership is inconsistent. Symptoms come late or not at all. Systems that record events but fail to connect them to continuous viewing.
AI relies on that continuity. Without it, the model fills in the gaps so the result looks polished but lacks substance. This is where many teams get stuck.
A better model doesn’t fix fragmented, old, or commercial data. Gartner estimates that organizations lose an average of $12.9 million annually due to poor data quality. AI doesn’t solve that problem, it presents it quickly and on a large scale.
Mirror test
There is a quick test for this. Give your AI the right, highly targeted customer signal and see what comes back. If the output is normal or insignificant, the model needs work. But if the model produces something sharp and useful from the clean data, and then diverges from the actual production data, the problem is the data.
Actually, it’s almost always the second case. AI acts like a magnifying glass, so that strong data systems become more powerful, and weaker ones become more visible. Organizations that have been focusing on disparate, poorly integrated customer data can no longer hide behind manual reporting and interpretation. AI clearly presents a problem.
Context is a new layer of identity
This is where the next evolution gets interesting. Even after solving the data quality problem, there is still a second change going on in the way customer profiles are created and used.
For years, business data systems have stored content: transactions in CRMs, demographics in data warehouses, campaign responses in marketing platforms. These records describe what has happened. They were useful for reporting but were not designed for AI.
AI needs context. Content is not a static record. A current view of the customer including recent behavior, cross-channel signals, and emerging intent. A string that connects one connection to the next. Identity tells you who you are. Context tells you what they are doing and what they are likely to do next.
Consider a simple example: ask AI to recommend a beach vacation destination, and it might suggest Hawaii or Florida. Tell it you have three kids, and it brings up family-friendly options. It gave access to your recent search patterns, your affordability signals, and where you searched in the past year, and the recommendation changes completely because the model no longer works on statistical categories but from a live picture of who you are and what you are doing right now.
Most business systems are designed to store state, not store context. They capture events, but they don’t maintain continuity between them.
That is the gap that AI presents.
But for workers, the challenge is not conceptual; it is for construction. Context does not live in a single system. It is divided between event streaming, product analysis tools, CRMs, data warehouses, and real-time pipelines. Bringing that together into something that can be used by an AI system requires moving from cluster-centric data models to streaming or creating real-time architectures, where signals are continuously consumed, resolved, and made available during forecasting.
This is where most AI efforts stop. The model is ready, but the context layer is not working. The systems are not designed to retrieve correct signals within milliseconds, or resolve identities across channels in real time. Besides, “context” is always information rather than possibility.
Architectures like the Model Context Protocol (MCP) accelerate this change by giving AI systems a way to transfer memory about a user between applications, essentially processing a continuous line of context around each individual in a different interaction. The result is a much richer and more predictable profile over time, one that creates a line of continuity between what you’ve done, what you’re doing now, and what you might do next.
If that identity layer is strong, the same model produces better results. If it is weak, no model can compensate.
The benefit of integration
Organizations that built first-party data systems and long-lasting proprietary infrastructure ahead of the AI wave are now benefiting from the compounding effect. Better data trains smarter models. Smart models attract the most approved users. Many permitted users produce rich behavioral signals.
Competitors without that foundation cannot replicate this, no matter what model they use. The gap is structural, not algorithmic, and because identity systems evolve over time, organizations that start investing early have advantages that are really hard to close.
What does this mean in practice
The practical impact is a change in where AI investments are going. Organizations that get consistent results from AI treat it as the processing layer of a living data system, not as a standalone capability tied to existing infrastructure.
For builders and operators, this translates into a different set of priorities than the last two years of AI testing:
First, a real-time signals tool. Batch pipelines and nightly updates are not enough if AI systems are expected to respond to user intent as it happens. Teams need event-driven architectures that capture and display behavioral signals in near real-time.
Second, it enables the context to be retrieved during prediction. It is not enough to store data in a warehouse. Systems must be designed in such a way that relevant context can be resolved and entered into notifications or retrieved by agents within milliseconds.
Third, invest in identity solutions as infrastructure. Connecting different signals across devices and channels so that the system understands real people rather than anonymous interactions is fundamental, not optional.
Fourth, manage governance and consent as part of system design. First-party data built on trust isn’t just safe; stronger and ultimately more valuable than third-party data that competitors can access.
These investments are less visible than the launch of a new model and are more difficult to copy.
A real race
The models are now interchangeable. The difference will come from who can use context at scale and treat the model as a processing layer, not a benefit.
That benefit comes from years of investment in proprietary infrastructure, first-party data, and systems that keep customer content current.
The organizations that win will not be the ones with the best information. It will be those whose systems understand the customer before the information is written.
